Achieving explainability in AI is challenging due to the inherent complexity of modern machine learning models, trade-offs between accuracy and transparency, and the varying needs of stakeholders. Many high-performing models, like deep neural networks, operate as “black boxes” where decisions are based on intricate patterns across millions of parameters. For example, a vision model classifying images might detect combinations of edges, textures, and shapes that are not easily mapped to human-interpretable concepts. Simpler models like decision trees or linear regression are easier to explain but often lack the predictive power of complex architectures, forcing developers to choose between performance and clarity.

Technical limitations in explanation methods also pose challenges. Tools like LIME (Local Interpretable Model-agnostic Explanations) or SHAP (SHapley Additive exPlanations) approximate model behavior but have their own constraints. LIME generates local explanations by perturbing input data and observing changes in predictions, but these explanations may not reflect the model’s global logic. SHAP provides feature importance scores but becomes computationally expensive for large models or datasets. For instance, explaining a single prediction from a transformer-based model using SHAP might require hours of processing. Additionally, methods like attention weights in NLP models are often misinterpreted as direct explanations, even though they don’t always correlate with decision-making logic.

Stakeholder diversity and regulatory demands further complicate explainability. A data scientist might need granular details about feature interactions, while an end-user may require a plain-language summary (e.g., “Your loan was denied due to low income”). Regulations like the EU’s GDPR mandate “meaningful information” about automated decisions, but translating technical explanations into actionable insights is nontrivial. For example, a healthcare model predicting patient risk might output a probability score, but clinicians need causal factors (e.g., “high blood pressure contributed 40% to the prediction”). Striking this balance without oversimplifying or overwhelming users remains a key hurdle, especially when biases in training data could lead to misleading explanations.
